Start on Connect Failing

Currently using AVD with Pooled Apps and two session hosts. I have start on connect enabled and followed this article https://learn.microsoft.com/en-us/azure/virtual-desktop/start-virtual-machine-connect when setting it up. On step 5 of the document, I am using the first set of permissions:

Microsoft.Compute/virtualMachines/start/action
Microsoft.Compute/virtualMachines/read
Microsoft.Compute/virtualMachines/instanceView/read

It worked for several weeks, but in the last week or so have been getting errors when attempting to use. AVD agent on session hosts is version 1.0.4009.1500. Windows client is 1.2.2851.0

While both sessions hosts are stopped (deallocated) The error we receive from Windows or Web client when attempting start on connect is: There was a problem connecting to the remote resource. Ask you network administrator for help. Error code: 0x3000008 Extended error code: 0x0.

If I start VM session hosts in Azure portal, we connect without issue.

Any help is appreciated.
