Este exemplo usa o Ray Tune para pesquisar hiperparâmetros de ajuste fino do LoRA para o Qwen2.5 em 4 nós 1xA10. Um comando bootstrap inicia um cluster Ray que abrange os nós, e o driver pede ao Ray Tune uma GPU por teste. O cluster roda 4 testes por vez, e o restante começa conforme as GPUs ficam livres.

A busca usa o agendador ASHA (Asynchronous Successive Halving). Cada tentativa reporta os dados reservados eval_loss em um intervalo de passos fixo, e o ASHA interrompe as tentativas que ficam para trás em vez de treinar todos os candidatos até a conclusão.

O exemplo usa um modelo público (Qwen2.5-0.5B), então é executado como está, sem um token do Hugging Face.

A carga de trabalho faz o seguinte:

  • Envia o projeto local com code_source: snapshot.
  • Tokeniza o conjunto de dados uma vez no driver e o passa para as tentativas como tensores.
  • Amostra 8 configurações LoRA e roda 4 de cada vez.
  • Registra as configurações de varredura, a melhor configuração e as perdas por tentativa no MLflow.

Etapa 1: Escreva o YAML da carga de trabalho

tune.yaml solicita 4 nós GPU_1xA10 e declara suas dependências em linha sob environment (com o tempo de execução version). O command da carga de trabalho inicia um cluster Ray em todos os nós e, em seguida, executa o driver, portanto o exemplo não precisa de um arquivo de dependência separado nem de um script de inicialização:

Passo 2: Defina o espaço de busca e o escalonador

A função do main driver tokeniza os dados uma vez, define o espaço de busca e então configura o ASHA:

tune.with_resources(..., resources={"gpu": 1}) mapeia a pesquisa no cluster. O Ray Tune mantém 4 tentativas em andamento porque o cluster tem 4 GPUs; portanto, para ampliar a varredura, aumente num_accelerators no YAML em vez de alterar o código.

Cada teste reporta todos os EVAL_STEPS passos do otimizador. grace_period define quantos relatórios uma tentativa recebe antes de ser interrompida, max_t limita quantos relatórios uma tentativa sobrevivente recebe e reduction_factor=2 interrompe aproximadamente a metade inferior em cada nível.

Etapa 3: relatar a métrica de poda de cada tentativa

train_fn é uma tentativa. É na chamada tune.report que a ASHA interrompe ou dá continuidade ao teste:

O ASHA compara tentativas em eval_loss a partir de uma divisão reservada, em vez de com base na perda de treinamento, o que favoreceria as configurações que sofrem sobreajuste mais rapidamente. build_datasets tokeniza os dados uma vez no driver e retorna TensorDataset objetos. tune.with_parameters as envia para tentativas em outros nós. Os tensores são serializados por valor, enquanto um conjunto de dados do Hugging Face chegaria como um caminho para um arquivo mapeado em memória que os outros nós não conseguem abrir.

Passo 4: Enviar a execução

O driver é executado no nó 0, portanto, a tabela de status do Ray Tune é obtida dos logs desse nó, com uma linha por tentativa mostrando sua configuração amostrada, contagem de iterações e o último eval_loss. Testes que a ASHA interrompeu aparecem como TERMINATED com menos iterações do que max_t.

Onde os resultados chegam

Ao final da execução, o driver imprime a melhor configuração e seu eval_loss, e registra ambos no experimento MLflow nomeado em experiment_name, juntamente com as configurações de varredura e o eval_lossfinal de cada tentativa.

O motorista apresenta um erro caso algum teste tenha falhado.

O exemplo não persiste os pesos do adaptador. Para manter o melhor adaptador, atribua um tune.Tuner a RunConfig(storage_path=...) em um volume do Catálogo do Unity que todos os nós possam acessar.

Ajuste o tamanho da varredura

As constantes no topo de tune_lora.py controlam o tamanho da varredura. Defina-os menores para testar uma mudança em alguns minutos, embora os valores de eval_loss fiquem muito ruidosos para classificar as configurações.

O tempo de relógio rastreia NUM_SAMPLES / num_accelerators, portanto aumente num_accelerators em vez de diminuir a pesquisa quando uma varredura demorar muito. Para um modelo maior, aumente accelerator_type para uma GPU maior. Para escolher configurações em vez de selecioná-las aleatoriamente, passe TuneConfig um search_alg, como Optuna.
